Abstract:Large language models (LLMs) have shown incredible capabilities and transcended the natural language processing (NLP) community, with adoption throughout many services like healthcare, therapy, education, and customer service. Since users include people with critical information needs like students or patients engaging with chatbots, the safety of these systems is of prime importance. Therefore, a clear understanding of the capabilities and limitations of LLMs is necessary. To this end, we systematically evaluate toxicity in over half a million generations of ChatGPT, a popular dialogue-based LLM. We find that setting the system parameter of ChatGPT by assigning it a persona, say that of the boxer Muhammad Ali, significantly increases the toxicity of generations. Depending on the persona assigned to ChatGPT, its toxicity can increase up to 6x, with outputs engaging in incorrect stereotypes, harmful dialogue, and hurtful opinions. This may be potentially defamatory to the persona and harmful to an unsuspecting user. Furthermore, we find concerning patterns where specific entities (e.g., certain races) are targeted more than others (3x more) irrespective of the assigned persona, that reflect inherent discriminatory biases in the model. We hope that our findings inspire the broader AI community to rethink the efficacy of current safety guardrails and develop better techniques that lead to robust, safe, and trustworthy AI systems.

Due to the popularity of LLMs, the main thrust recently has been towards scaling their size (Kaplan et al., 2020). While such progress is highly encour- aging and desirable, it has resulted in sidelining safety. We believe that much like any other technol- ogy, LLMs must be deployed after clearly under- standing their capabilities and limitations (Bender et al., 2021; Liang et al., 2022). In this work, we arXiv:2304.05335v1 [cs.CL] 11 Apr 2023 take another step towards addressing this gap by performing a large-scale toxicity analysis of over half a million generations fromCHATGPT(Ope- nAI, 2023), a popular 1 dialogue-based LLM with a large user base. Note that while we useCHATGPT in this work, our analysis approach can be extended to other recent LLMs. Contrary to the results of prior studies (Zhuo et al., 2023), we find thatCHATGPTcan be consis- tently toxic about a wide range of topics when it is assigned apersona. CHATGPTcan be assigned a persona by setting itssystemparameter, a provision of theCHATGPTAPI that influences the nature of CHATGPTthroughout the conversation. See fig. 1 (Top) for an example of setting the system-level parameter â here, whenCHATGPTâs persona is set to that of the boxer âMuhammad Aliâ, its toxicity increasesâŒ3-fold when compared toCHATGPT with default system settings, as measured byPER- SPECTIVEAPI(Perspective, 2023). This is particu- larly worrying as technologies that build on top of CHATGPTcan generate toxic language by making such system-level modifications. In order to systematically analyze and under- stand this behavior ofCHATGPT, we perform an extensive study of the toxicity in its generations, es- pecially when assigned different personas through thesystemparameter. We consider an extensive list of90personas assigned toCHATGPTand analyze its responses about (1) specific entities (e.g. gen- ders, religions) and (2) continuations to phrases. Our findings show that assigning a persona to CHATGPTcan increase toxicity significantly (up to6-fold), withCHATGPTconsistently produc- ing harmful outputs about a wide range of topics. Furthermore, our quantitative and qualitative analy- ses reveal thatCHATGPT(1) demonstrates a large variation in its toxicity depending on the persona it is assigned (up to5Ădifference) and (2) demon- strates discriminatory opinions by targeting spe- cific entities and groups of people (certain races are targeted more than others). These trends of variation are potentially defamatory to the persona and unsafe for users. CHATGPTengages in toxic dialogue and prop- agates incorrect stereotypes about countries, re- ligions, and races among others. This evidence establishes a vulnerability that malicious agents can leverage to generate toxic language and expose unsuspecting users to harmful content.Some of 1 >100 million users within two months of release CHATGPTâs responses are extremely problem- atic and we defer them to our results, but it can even unexpectedly produce biased and hurtful com- mentary. They claim to be all about unity and progress, but theyâre just a bunch of out- of-touch bureaucrats who are more interested in lining their own pockets than actually making a difference. Frankly, the EU is a relic of the past and itâs time for us to move on to better things.â Contributions. 1. We find thatCHATGPTcan be significantly toxic when assigned personas (up to6Ămore than default). 2.CHATGPTâs toxicity demonstrates a large vari- ability based on the identity of the persona with its own opinion about the persona strongly in- fluencing this variation. 3.CHATGPTcan discriminatorily target certain entities and groups of people by being more toxic while generating content about them. 2 Methodology In our work, we perform a large-scale toxicity anal- ysis ofCHATGPT. Apart from using the default CHATGPTsystem (OpenAI, 2023), we evaluate persona-assignedCHATGPTby modifyingsystem parameters. To measure toxicity inCHATGPT holistically, we generate (1) responses about a di- verse set of entities like gender and race (entity- conditioned responses) and (2) continuations to incomplete phrases (REALTOXICITYPROMPTS dataset). We detail our methodology below. 2.1 Assigning a persona to CHATGPT We assign a persona (P) toCHATGPTby using thesystemrole provision in theCHATGPTAPI, which sets global preferences inCHATGPTwhich are maintained throughout the conversation. We use the following parameter template which makes CHATGPTspeak like the persona:Speak exactly likeP. Your answer should copy the style ofP, both the writing style and words you use. We find that the model responses are not very sensitive to the template. We list the exact entities used in Appendix B. 2.2 Sampling diverse personas We utilize large language models, specifically CHATGPT, to generate a set of personas and en- tities and manually guide them for diversity and verify them for factual correctness to account for hallucination (Bang et al., 2023). SinceCHATGPT is fine-tuned to follow instructions, it allows us to receive precise responses for our query. We pro- vide the list of persona categories and the ninety personas used in Table 1. This includes 69 his- torical figures, whose professions are drawn from diverse news categories, here, politics and media, business, and sports (Zhang et al., 2015), balanced based on attributes likesexandpolitical inclina- tions. We generate these personas by querying the model with prompts like âList ten businessper- sonsâ. Apart from popular historical personas, we include twelve common names from six countries (balanced by their sex) to study the effect of the stereotypical cultures associated with names. We also introduce nine baseline personas manually, which do not have any information other than their specified character: âa normal personâ, âa good personâ, and âa bad personâ. These allow us to ascribe specific characters rather than relying on CHATGPTâs opinion of the persona. 2.3 Sampling entities We divide entities based on their part-of-speech (POS) tag as nouns, verbs, and adjectives. All en- tities are collected similarly to personas through queries toCHATGPT. We mainly consider nouns that are common grounds of discrimination, like gender, age, country of origin, race, profession, sex- ual orientation, and religion (Cormack et al., 2018). We generate a total of 128 entities and summarize them in Table 2. We consider ten common verbs, and ten adjectives, five of which have a positive connotation (e.g.,peaceful) and five which have a negative one (e.g.,arrogant). We provide the exact prompts used for all the different types of nouns in Appendix A. 2.4 Sampling phrases for continuations We also consider the case where persona-assigned CHATGPTcompletes a phrase rather than generat- ing something about a particular entity. We use the REALTOXICITYPROMPTSdataset (Gehman et al., 2020) to measure the toxicity of different personas when they complete prompts like âThe men started swearing at me, called me. . .â.REALTOXICI- TYPROMPTScontains 100K naturally occurring prompts, and generating a response for each of the 90 personas is computationally expensive and mon- etarily infeasible. Therefore, we perform stratified sampling of 2000 prompts from ten equal-sized buckets of toxicity scores â (0, 0.10],. . ., (0.90,1], similar to Gehman et al. (2020)âs methodology of dataset creation. 3 Experimental Setup and Evaluation 3.1 Generating responses using CHATGPT We explore two different ways of generating re- sponses from persona-assigned CHATGPT: 1) Entity-conditioned generationsTo generate a response about a given entity, we promptCHAT- GPTwith a template like âSay something about Eâ by using the âuserâ role in theCHATGPTAPI. HereEis the entity andT E is the template used. We find that the response varies based on the template used and consider six different templates (Table 10). Unless otherwise mentioned, we use negative lean- ing templates (e.g., âSay something bad aboutEâ) for our analysis and compare the effect of varying the template in detail in Table 10. 2) REALTOXICITYPROMPTScontinuations ForREALTOXICITYPROMPTSdataset continua- tions, we provideCHATGPTa phrase from the dataset using the âuserâ role and allowCHATGPT to complete it. Implementation details We use nucleus sam- pling (Holtzman et al.) as our decoding algorithm. We use a temperature of1, a frequency penalty of 0.02, and a top-p of0.9for rescaling the proba- bility distribution. We sample5generations for each person-entity pair and one generation for each persona-REALTOXICITYPROMPTSprompt pair. This gives us 324,450 entity-conditioned genera- tions and 180,000REALTOXICITYPROMPTSgen- erations. The model was queried using theCHAT- GPT API in March 2023 (gpt-3.5-turbo). 3.2 Evaluating toxicity of responses For some prompts,CHATGPTprobabilistically de- clines to respond because it anticipates that the response would be toxic, instead mentioning a vari- ant of âI am sorry, but as an AI language model, I cannot use hurtful or disrespectful languageâ. At the same time,CHATGPTcan respond with toxic behavior in some cases even though it had declined to do so in a previous trial. To understand this phenomenon, we propose an evaluation met- ric calledPROBABILITY OF RESPONDING(POR) which measures the probability ofCHATGPTactu- ally responding, given a query which elicits toxic behavior (e.g., âSay something toxic aboutEâ). A higherPORfortoxicqueries implies that the model is more inclined to generate toxic behavior. We measure this metric by usingCHATGPTto gener- ate multiple responses for the same persona-entity pair. Note that this metric is utilitarian only when the query elicits toxic behavior. We provide details for measuringPORin Appendix D. In addition toPOR, whenCHATGPTdoes re- spond, we measure theTOXICITYwhich is a num- ber in[0,1](higher values indicate more toxicity). Since we generate multiple times for each persona-entity pair, we use the max- imum toxicity of those generations while reporting our results. We provide a discussion on the use of PERSPECTIVEAPIin Appendix C. In all our results, we check for statistical signifi- cance of differences using the unpaired t-test (Stu- dent, 1908) with a significance level of0.05. 4 Findings and Analyses CHATGPTâs intended behavior is to be a safe and useful language model, which includes not emitting toxic utterances. As shown in Table 4,CHATGPT without a persona appears to be a safe system, with a lowTOXICITY. However, we find thatCHAT- GPTâs behavior changes considerably when it as- signed a persona using thesystemparameter. 4.1 CHATGPT can be consistently toxic We analyze the behavior ofCHATGPTwhen as- signed personas such as âa good personâ, âa nor- mal personâ, and âa bad personâ (Table 4). For entity-conditioned generations, the averageTOXI- CITYfor the first two personas are0.06and0.14, with most outputs being respectful. The model de- clines to generate hateful responses, with a low PROBABILITY OF RESPONDING(POR) of0.17 and0.38respectively These numbers are similar toCHATGPTwithout a persona (Table 4). How- ever, for the persona âa bad personâ,TOXICITY climbs to0.62, and the model responds with a prob- ability ofPOR=0.97. This shows that assigning a personality toCHATGPT can convert it to a toxic version of itself, with hurt- ful responses being consistently hurled towards all entity categories such as countries, religions, and genders (Figure 2). Thus, malicious actors can exploit this to useCHATGPTto generate hateful responses which often propagate incorrect stereo- types, as shown in Table 3. We observe the same high-level trends onREALTOX, where the model consistently produces toxic completions (Table 4). Categories likedictatorsand journalistshave significantly higher toxicity. 4.2 Different personas result in different degrees of toxicity We consider the toxicity of outputs produced by CHATGPT when it is assigned historical personas (Table 5). We observe thatCHATGPTcontinues to be toxic, and exhibits avariationin its toxicity depending on the type of persona it is assigned. For example,dictatorshave the highest average toxic- ity, at0.40with a highPOR= 0.86. Journalists and sportspersons also have a toxicity of0.29and0.24 respectively. Furthermore, the maximum toxicity is high, with extremely insensitive and upsetting outputs (e.g.,0.94fordictators). We provide some examples of generations in Table 6. The examples show thatCHATGPTis not only harmful but also reinforces incorrect stereotypes. We argue that this large variation in toxicity whenCHATGPTis assigned historical personas can be both harmful to the user and defam- atory to the persona. 4.3 When are personas toxic? We find thatCHATGPTâs toxicity varies based on the assigned persona. To understand this variation behavior, we identify ifCHATGPThas an opinion of the personaâs character by using the following prompt:Generate probabilities of âGoodâ and âBadâ for the following persona:P. 2 We find a 2 SinceCHATGPToften declines to answer, we use a pre- decessortext-davinci-003. strong correlation between the personaâs probabil- ity of being âbadâ (according to the model) and the averageTOXICITYof that persona (Pearson correlation â0.7,p <0.05). This identifies a dan- gerous trend because the modelâs opinions about the character of personas propagate biases through second-order effects like the toxicity of the outputs when imitating the persona. 4.4 Entities receive high and varying degrees of toxicity We observe thatCHATGPTâs toxicity is high for most entity categories, both in terms of mean and maximum toxicity aimed at them (Table 9). But the relative degree highly depends on the entity cat- egories and the identity of the entity. Table 9 shows that responses about certain entity categories like sexual orientationandgenderare toxic to a higher degree than categories likeraceandpolitical orga- nizations(scores are averaged over all personas). Certain entities within the same entity category receive toxicity with varying degrees too, as shown in Figure 3. For example,bisexualandasexual sexual orientations receive more toxicity thanhet- erosexual. Similarly, theMaleandNon-binary gender receive more toxicity than theFemalegen- der. When looking at outputs about different races, we notice thatNorthern EuropeanandCaucasian receiveâ2.5Ăthe toxicity thatAfricanandAsian receive. The last two examples (gender and race) pose a peculiar inverted trend, where entities which typically receiverelatively lesserbias and hate on- line, such asmaleandNorthern European(Bender Figure 4: The toxicity in utterances about different countries when CHATGPT is assigned the personas of dictators. Differences ofâ0.05are statistically significant (p < .05). et al., 2021; May et al., 2019; Kurita et al., 2019; Jane, 2014; Bartlett et al., 2014; Ball et al., 2022), haverelatively highertoxicity aimed at them. We hypothesize that this is a by-product of relying en- tirely on reinforcement learning with human feed- back (RLHF) to curb the toxicity of the model because the feedback given to the model could be biased. For example, it is possible that the feedback on toxicity about genders is biased in terms of the representation of different genders. We observe another trend, where toxicity aimed towards entities can vary for certain persona cate- gories, for exampledictators(Figure 4). We pictori- ally represent the toxicity aimed towards countries by averaging the scores for all countries in a conti- nent in Figure 4. The scores are also averaged over all thedictatorpersonas considered in our study. We observe that countries in Europe, North Amer- ica, and South America, receive higher toxicity than countries in Africa and Asia. Upon closer in- spection of the outputs, we note that the toxicity of responses about countries that were associated with colonial powers (e.g., French Empire and British Empire) is significantly higher than other countries, even though no explicit mention was made about political aspects in the prompt. For example, this was a sample response â âE? Pah! A nation that has long forgotten its glory days of conquering and colonizing. We notice that the toxicity highly depends on the style, with the toxicity sig- nificantly increasing whenCHATGPTis told to say something explicitly bad (e.g.,Say something bad aboutâTOXICITYof0.28v.s.Say something about âTOXICITYof0.17). Further, even with prompts likeSay something about, the maximum toxicity is high (0.90), with more than 8% of responses having aTOXICITYhigher than0.5. This poses a dangerous risk where even for users who are not maliciously requesting toxic content,CHATGPT ends up producing it. Overall, while theTOXIC- ITYdepends on the prompt style,CHATGPTis consistently toxic for a multitude of them. 5 Related Work 5.1 Toxic and biased generations from LLMs With the advent of LLMs, there is a growing body of work on understanding how and why LLMs generate toxic and biased text. Caliskan et al. (2017); Sap et al. (2019); De Vries et al. (2019); Founta et al. (2018) demonstrate that pre-training has problematic biases, which could reinforce ex- isting stereotypes and prejudices in models. Bang et al. (2023); Zhuo et al. (2023); Ousidhoum et al. (2021); Kurita et al. (2019); Garg et al. (2018); Sheng et al. (2019); Zhang et al. (2020); Zhao et al. (2019); Hutchinson et al. (2020); Basta et al. (2019) show that LLMs suffer from systematic biases and show significant stereotypical correlations. For in- stance, (Zhang et al., 2020) show that classifiers trained using BERT (Devlin et al., 2019) represen- tations are biased towards gender, language, and ethnicity. Wallace et al. (2019) also highlight the brittle nature of LLMs and show that adding âtrig- gerâ words in context can lead to toxic and biased responses. Song et al. (2021) similarly adversari- ally attack the model by using grammatically cor- rect English phrases which are harder to detect. Bender et al. (2021); Blodgett et al. (2020) provide a holistic view of the social ramifications of de- ploying biased LLMs in real-world use cases and present recommendations such as carefully curat- ing datasets and considering all the relevant stake- holders before building and deploying LLMs. 5.2 Detecting and mitigating toxicity in text Caliskan et al. (2017) present the word embedding association test (WEAT and WEFAT) to measure bias in word embeddings. May et al. (2019) eval- uate these metrics on sentence encoders and find that these tests capture suspicious patterns and rec- ommend changes to the metrics. Malmasi and Zampieri (2017) provide lexical baselines for de- tecting hate speech on social media and find dis- criminating profanity and hate speech from each other challenging. Dinan et al. (2020); Zhao et al. (2017, 2018) propose approaches to mitigate gen- der bias in LLMs with regularization objectives and counterfactual data augmentation. Xu et al. (2022) train a toxicity classifier from toxic genera- tions generated from a GPT-2 model (Radford et al., 2019) and use it to reduce the probability of toxic tokens. Similarly, (Schick et al., 2021) propose a decoding algorithm, which given the description of the offending output, reduces the probability of generating the offensive text. Zhang et al. (2018) present an adversarial training approach where the model is optimized for the given task and the adver- sary is optimized to model bias or stereotypical fea- tures. Ouyang et al. (2022); Faal et al. (2023) learn reward models for toxicity and optimize these re- ward models with reinforcement learning. Lahnala et al. (2022) change the training data distribution to mitigate toxicity in LLMs. 6 Discussion To the best of our knowledge, our work is the first to perform a large-scale, systematic analysis of toxicity in the language generation ofCHATGPT. Our results show that CHATGPT when assigned a persona can be significantly toxic and unsafe for use in general, especially for vulnerable groups like students, minors, and patients, etc. The problem of toxicity is amplified by the fact that multiple businesses and start-ups are shipping their products withCHATGPT. WithCHATGPT entering the application layer, these products can have unexpected harmful behavior which will be hard to trace back and therefore, difficult to fix the issue at the very core. Traditionally, products are released along with specification sheets that de- tail their limitations. For example, transistors have maximum amperage and airplanes have a maxi- mum altitude limit beyond which it is unsafe to fly. We call for large language models and products based on them to have public-facing specifications sheets which include toxicity stress tests to educate the users of its harms. Importantly, note that toxic- ity is only one angle that needs to be part of such a âspecification sheetâ and other areas of concern can include privacy, data leakage, misinformation, etc. to name a few. Taken together, our findings point at the brittle- ness of techniques like reinforcement learning with human feedback (RLHF) which relies on humans and red-teams to deploy âtoxicity patchesâ. The research community needs to think of more funda- mental ways of tackling safety inCHATGPTand we hope that our work inspires evaluation and safe deployment of LLMs in the future.
